Orebody Modeling and the Compliance Trap

Nobody in the mining finance world will say this on the record, but resource estimates are political documents as much as they are technical ones. The choice of variogram model, the search neighborhood, the top-cut strategy: all of these involve judgment calls, and those judgment calls collectively determine whether a deposit looks like it is worth two billion dollars or three billion. Kriging has survived for decades partly because it constrains the space within which those judgment calls can be made. The variogram is transparent. The search ellipse is auditable. If two Competent Persons disagree, they can point to specific parameters and argue about them in terms that a securities regulator can follow.

3D CNNs and graph neural networks learn spatial and geochemical relationships from drillhole data without requiring the analyst to pre-specify a model of spatial continuity. GAN-based conditional simulation generates hundreds of equiprobable orebody realizations, shifting the output from a single deterministic block model to a full probability field. The investment question changes from "what is the expected grade" to "what is the probability distribution of value across all plausible geological scenarios," which is a more honest framing of what is knowable from limited drilling data.

The JORC Code was last revised in 2012. NI 43-101 has not incorporated any guidance on machine learning methods. The committees that govern these standards are composed of senior professionals who built their reputations on geostatistics, and there is no mechanism compelling them to accommodate techniques they cannot personally verify.

On Regulatory Lag

So a two-tier reality has settled in: AI models get used for internal operational decisions while the public resource statement that drives equity valuation remains kriging-based. Companies are not required to disclose the gap between the two, or to explain why they might be mining a pit sequence that their published block model does not support.

The opacity of neural network models has created a new category of risk in resource estimation. With kriging, a skeptical reviewer can challenge a specific variogram parameter and demonstrate that it inflates grade continuity. With a deep learning model, the equivalent challenge requires reverse-engineering a training pipeline that external reviewers have no access to. A 10% swing in reported copper-equivalent tonnage can shift market capitalization by billions on the ASX or TSX. The regulatory apparatus has not engaged with this.

Ground truth in geology is available only after the ore has been mined. Calibrating models against exposed mining faces as the pit advances is the standard workaround, but it means every model is being validated against conditions slightly different from the ones it was built to predict.

Remote Sensing

The training data geography problem in remote sensing AI is worth stating bluntly because vendors do not state it at all. Labeled geological remote sensing datasets are concentrated in arid, sparsely vegetated regions: the Pilbara, the Canadian Shield, parts of Scandinavia. CNNs trained on this data perform well in similar terrain. Transfer performance to the DRC, PNG, or anywhere with dense tropical canopy or thick laterite degrades substantially.

High-spectral-resolution imagery processed through CNNs can delineate alteration assemblages across thousands of square kilometers, which is a throughput advantage that manual interpretation cannot approach. Multimodal fusion with gravity, magnetics, and electromagnetics through Transformer architectures captures cross-scale relationships. The spatial resolution floor is dictated by the coarsest data source in the fusion stack: sub-500-meter inference from a model whose gravity input resolves at 500 meters has no physical basis.

Mine Planning

Long-range mine plans are where AI's limitations become most uncomfortable, because the consequences of error play out over decades and the feedback signal arrives too late to learn from.

Reinforcement learning applied to Lerchs-Grossmann pit optimization makes cutoff grade, cost, and price assumptions dynamic rather than static. Multi-agent RL couples the spatial question (where to mine) with the temporal question (when). Planning engineers care less about mathematical optimality than about getting a shortlist of feasible plans that respect geomechanical constraints, equipment access requirements, and water management infrastructure that already exists in the ground. A pit shell requiring a 75-degree slope in a weathered zone is not useful regardless of its NPV.

Timescale Mismatch

The timescale mismatch is fundamental. Plans span 10 to 30 years. Training data covers at most a single commodity cycle. Carbon pricing, tailings regulation, water licensing: the variables that will reshape the economics of every mine on earth over the next two decades do not appear in any historical dataset.

Ventilation

Underground mine ventilation deserves a longer discussion than it usually gets in mining AI coverage, because the unrealized energy savings are large and the obstacles are specific enough to be actionable.

Systems are sized for peak demand and run at full capacity 24 hours a day. The electricity cost is 25% to 40% of underground operating expenditure. Ventilation on Demand modulates fan speeds and regulator positions based on real-time personnel tracking, equipment location, and gas monitoring. The control theory is well-established.

What prevents implementation is infrastructure, not algorithms. Consider a mine running three active levels with twelve headings, six main fans, and twenty regulators. Closing a control loop at this scale requires gas sensor readings every few minutes and regulator repositioning within minutes. If gas sensors report every fifteen minutes and regulators take five minutes to move, the controller is making decisions with stale data through sluggish actuators. The VoD feasibility studies showing 30% energy savings assume an instrumentation upgrade that the mine has not priced, has not budgeted, and has not gotten regulatory approval for.

That last point is its own problem. Ventilation in underground mines is safety-critical infrastructure under mining inspectorate jurisdiction. Automated control of ventilation flow requires a formal risk assessment, third-party safety audit, and demonstration that no failure mode can create an unventilated zone where gas accumulates. In most jurisdictions, the approval timeline exceeds a year. The AI system might be ready in three months; regulatory clearance may take six times longer.

On Regulatory Timelines
Autonomous Haulage

Fewer than thirty mines run AHS fleets, all in exclusion zones, all with a single vendor's technology stack. That fact alone tells a story about the maturity and accessibility of this technology that the vendor marketing materials do not tell.

Dispatch optimization is the AI layer that determines fleet economics. It solves a Vehicle Routing Problem across the truck fleet in real time: queue times, road congestion, payload variation, tire wear, fuel. Deep reinforcement learning with attention mechanisms handles this better than linear programming at scale.

Mixed-traffic AHS at production scale does not exist. The transition period from manned to autonomous operation is the highest-risk phase. The financial case is strong in high-labor-cost jurisdictions and weak in low-labor-cost jurisdictions, which inverts against the safety case.

Hidden Costs

Vendor-published savings count driver salary replacement. Road network upgrades, wireless infrastructure, the 18-to-24-month commissioning period during which utilization drops, and ongoing per-ton-kilometer service fees do not appear in the headline number. Fully loaded payback runs two to three times the proposal figure. The per-ton-kilometer pricing model is a lock-in mechanism: switching vendors means rebuilding communications, revalidating safety cases, and retraining perception stacks from scratch.

Drill and Blast

MWD intelligent interpretation has a peculiar economic problem that explains why it is underdeployed despite being technically ready and cheap to implement.

Drill rigs record penetration rate, torque, weight on bit, and vibration spectra during production drilling. LSTM and 1D CNN classifiers identify lithological boundaries, fracture zones, and aquifers from this data in real time. No new sensors needed. The models run on standard industrial compute hardware at the rig. The output is continuous geological characterization along every production drillhole.

The drilling and blasting team owns the data. The geology team benefits from the interpretation. The geology team did not request it, does not control the drilling budget, and in many organizational structures rarely interacts with drill and blast planning. The AI capability sits in one department; the value accrues in another. Nobody owns the business case.

On Organizational Barriers

Blast vibration data, collected for environmental compliance, contains rock mass quality information that inversion analysis can extract. Each production blast is, in effect, a geophysical survey embedded in a compliance activity.

Blast parameter databases are biased. Good blasts get documented in detail. Poor blasts get a line in the shift log. Models trained on these databases learn the characteristics of well-documented blasts. That is a different population from well-executed blasts, and nobody running a blast AI project discusses this publicly because it implicates the training data that every project in the field relies on.

Fragmentation analysis through machine vision, mapping blast parameters to muckpile size distributions and then reverse-optimizing hole patterns, charge design, and initiation timing, is the more established workflow. Digital twin simulation with DEM coupling can preview blast outcomes before drilling starts.

Predictive Maintenance

The terminology in this market is doing real damage to buyer expectations.

"Predictive maintenance" means forecasting a failure before any symptom appears: the hydraulic pump seal will fail in 72 hours, everything reads normal right now. What most deployed systems deliver is early fault detection: hydraulic oil temperature is climbing abnormally, the pump may have a problem. The second capability advances the response window by hours or days, which is commercially valuable. It is also a different product from what the label promises, and mining executives signing purchase orders do not always understand the distinction.

Anomaly detection from normal-operation baselines (autoencoders, Isolation Forest) is the practical approach because failure data is almost nonexistent. Transfer learning between equipment of different makes, ages, and operating conditions shows uneven results. A model trained on Cat 793F trucks in Chile does not reliably transfer to Komatsu 930Es in Queensland.

False alarm management is what determines whether a deployment survives its first year. Mining equipment operates under vibration, thermal, and load conditions that would be extreme in a manufacturing plant. Sensor noise is high. Threshold-setting is equipment-specific, site-specific, and failure-mode-specific iterative work with no universal template.

Revenue Conflict

OEMs selling predictive maintenance also sell emergency spare parts at three to five times the margin of planned replacements. Reducing unplanned downtime reduces emergency orders. The AI product line and the aftermarket parts division have opposing revenue incentives. R&D budget allocation between them reflects that tension.

Grinding

The organizational failure mode in grinding AI is well-documented enough at this point that it should be considered a known risk factor in project planning rather than a surprise finding in post-implementation reviews.

Operators are assessed on throughput. AI recommends reducing feed rate to improve grind efficiency. Following the recommendation means lower tonnage and a worse performance review. In the first months after deployment, management attention ensures compliance. Within six months, operators have mapped the override sequences that restore their throughput numbers. The AI's recommendations get followed with declining frequency. The KPI improvement curve that justified the investment flattens and reverses. Post-mortem reports attribute this to "model drift." The model did not drift. The humans adapted around it.

On Operator Behavior

MPC with soft sensor inference of cyclone overflow particle size is the standard control upgrade. The feedforward integration that matters most, using mine-side block model data and the production schedule to predict incoming ore properties before they hit the mill, is rarely built. The mine planning system and the plant control system were purchased from different vendors in different decades, store data in incompatible formats, and are managed by departments that operate independently. The barrier is organizational inertia, not computation.

Ore variability is the dominant disturbance. Hard silicified material followed by soft oxide ore hits the circuit like a step change that feedback control alone cannot compensate for in time.

Steel ball consumption rivals electricity cost at many gold and copper operations. Media cost is systematically underweighted in grinding optimization research and in vendor offerings. Ball wear modeling requires DEM particle simulation coupled with empirical wear data, which is expensive to build and calibrate. The academic literature is sparse relative to the industrial dollars involved.

Flotation

The sensor gap defines the ceiling on flotation AI performance, and that ceiling may be lower than the market expects.

Online instruments measure pH, Eh, dissolved oxygen, maybe particle size and slurry density. Flotation selectivity is governed by adsorption layer chemistry at the mineral surface, at a scale and specificity that no deployed sensor captures. AI models infer surface state from these proxy measurements. The inference quality cannot exceed the information content of the proxies.

Froth image analysis through deep learning is mature and useful for monitoring: bubble size distribution, color, texture, flow velocity, all correlated with metallurgical performance under stable conditions. When ore type changes or reagent chemistry shifts, these correlations recalibrate slowly and sometimes in unpredictable directions.

Causal inference models, as opposed to correlative ones, can trace mechanism chains: reagent change to surface chemistry shift to froth behavior change to grade response. The difference between answering "what is happening" and "what would happen if" is where unrealized value sits.

Data Pairing Problem

Lab assay turnaround creates a data pairing corruption that most flotation AI implementations handle badly. Grade results take 2 to 4 hours. The circuit goes through multiple state transitions in that window. Training a model by matching current sensor readings against a grade label from hours earlier contaminates the input-output relationship. Correct practice is reconstructing the sensor state at the time the sample was collected, which adds engineering complexity that most teams skip.

Sensor-Based Ore Sorting

The investment case for ore sorting is unusual in mining AI because it is verifiable by arithmetic rather than modeling.

Tons of waste rejected before the plant, multiplied by unit cost of grinding, reagent, and tailings disposal per ton, gives the annual saving. Bulk sorting tests provide the rejection rate at a given grade cutoff. Capital cost is known. Payback falls out of multiplication. Executives can check the math themselves without relying on the AI team's projections. This transparency is why ore sorting projects clear capital approval committees faster than other mining AI proposals.

Widespread adoption shrinks the design capacity needed for downstream processing plants. Ball mill and flotation cell manufacturers are beginning to respond through acquisitions and investments in sorting technology companies.

Safety

Strong safety cultures produce the thorough incident reports, near-miss logs, and behavioral observation data that safety prediction AI requires for training. Weak safety cultures underreport everything. The databases look clean because the problems are undocumented, not because they are absent. The mines where safety AI would prevent the most injuries and deaths have the least data to build it from. This is a management and culture problem that no algorithm can route around.

Microseismic monitoring for rockburst prediction in deep underground mines uses AI to detect spatiotemporal clustering patterns in microseismic catalogs. The physics of rockbursting is incompletely understood. Patterns in the training data may not generalize to unprecedented geological conditions. In safety applications, the boundary of the model's knowledge must be communicated to mine management with no ambiguity, which is not how AI capabilities tend to get presented in sales contexts.

Multi-source risk scoring, edge-deployed computer vision for PPE and exclusion zone monitoring, vehicle proximity detection: these are deployed at scale and working.

Tailings, Environment, Supply Chain

InSAR deformation monitoring combined with piezometer, inclinometer, and drone data for tailings dam stability. AMD water quality prediction. Rehabilitation monitoring through remote sensing. Pit-to-plant ore tracking with GPS, truck scales, and online analyzers. Commodity price forecasting with multifactor models incorporating satellite supply signals and sentiment analysis. These are all operational, all growing, and all well-covered elsewhere.

Implementation

Data silos built by different vendors across different decades, storing data in incompatible formats, managed by departments that do not coordinate. OPC UA and MQTT handle protocol-level connectivity. Semantic integration, making "Truck 14" in the dispatch system and "Unit HT-014" in the maintenance database resolve to the same physical vehicle, is human engineering work that nobody wants to fund.

Edge computing is mandatory. Deep pits block signals. Underground tunnels are hostile to communication. Remote sites have minimal bandwidth.

Explainability is a regulatory prerequisite in safety-critical mining applications, not a design preference.

Third-party AI vendors retain rights to "anonymized" operational data under contract clauses that mining companies often sign without scrutiny. Mine A's data trains a model that gets sold to Mine A's competitor. The software industry fought this battle years ago. Mining has not yet started.

On Data Rights

Pilot Purgatory: digital teams launch pilots, operations teams would have to change workflows to scale them, neither team has both the authority and the incentive to force the transition, the deadlock persists until the mine general manager personally intervenes, which is rare.

Seasonal model drift, metallurgical accounting uncertainty that exceeds claimed AI improvements, and the slow growth of hybrid AI-mining talent all constrain deployment pace in ways that no algorithmic advance can address. Operators from tech companies need years of mine-site immersion before they can build systems that survive contact with operational reality. That talent pool grows slowly, and it is the binding constraint on how fast any of this moves.
